التدهور نفسه ليس عملية واحدة. من بين أنماط تدهور البطارية المذكورة بشكل شائع: فقدان المواد الفعالة في القطب الموجب، وفقدان المواد الفعالة في القطب السالب، وفقدان مخزون الليثيوم [12]. ولأن هذه الأنماط يمكن أن تتجمع بطرق مختلفة عبر التركيبات الكيميائية والأشكال وظروف التشغيل، فإن نموذجاً مُدرَّباً على إعداد ضيق واحد قد لا ينتقل جيداً إلى إعداد آخر. وهذا بالضبط ما يثير القلق بشأن قابلية التعميم في مجموعات البيانات الحالية.

القطبان: الفيزياء القائمة على النموذج والتعلم القائم على البيانات
تتناقض عائلتان واسعتان بشكل مباشر في المصادر. يمكن التنبؤ بسعة ومقاومة البطارية عبر الإنترنت باستخدام نماذج جبرية مخفَّضة الرتبة، ومراقبات الحالة مثل مرشحات كالمان الموسعة (extended Kalman filters) والمرشحات الجسيمية (particle filters) المقترنة بنماذج الدارة المكافئة أو النماذج الكهروكيميائية، وطرق التعلم الآلي [12]. وبشكل منفصل، يمكن لطرق RUL القائمة على النموذج أن تؤدي بشكل أفضل من الطرق القائمة على البيانات عندما يُنمذج تدهور النظام بدقة [14]. هذا بيان مشروط، وليس ترتيباً عاماً: تفوق الطرق القائمة على النموذج يعتمد على مدى دقة نمذجة التدهور.
وتلك الدقة لها ثمن. تتطلب طرق RUL القائمة على النموذج معرفة مسبقة واسعة بالنظام ونموذجاً دقيقاً جداً، وقد يتضمن ذلك حسابات مكلفة [14]. تتطلب نماذج البطارية القائمة على الفيزياء موازنة بين الدقة والتعقيد لأنها تحتاج إلى العديد من المعلمات (parameters)، بينما تحتاج نماذج التعلم الآلي إلى مجموعات بيانات تدريب كبيرة وقد تفشل في التعميم على سيناريوهات غير مرئية [9]. لذا لكل قطب نمط فشل مميز: نماذج الفيزياء تفشل عندما لا يمكنك ضبط عدد كافٍ من المعلمات بشكل صحيح، ونماذج التعلم الآلي تفشل عندما لا يمكنك الحصول على بيانات تمثيلية كافية.
من جهة البيانات، تستخدم طرق التشخيص القائمة على البيانات (data-driven prognostics) التعرف على الأنماط لاكتشاف التغيرات في حالات النظام [14]. تتطلب الطرق القائمة على البيانات عموماً كمية كبيرة من بيانات التدريب، وعادة ما تنتج فترات ثقة أوسع مقارنة بالطرق القائمة على النموذج [14]. الشبكات العصبية الاصطناعية، وآلات المتجهات الداعمة (support vector machines)، وسلاسل ماركوف الخفية (Markov hidden chains) من بين الخوارزميات القائمة على البيانات المستخدمة في التشخيص [14]. يمكن للشبكات العصبية الاصطناعية نمذجة أنظمة غير خطية للغاية ومعقدة ومتعددة الأبعاد دون معرفة مسبقة بسلوك النظام [14]، وهذه هي جاذبيتها الرئيسية، لكن أساليب الشبكات العصبية لا توفر حدود ثقة تحليلية للتنبؤات بـ RUL [14]، وهذا هو قيدها الرئيسي عند النشر في سياقات ذات صلة بالسلامة.

التعلم الآلي القائم على الفيزياء: ما هو وكيف يعمل
تحاول الطرق القائمة على الفيزياء إبقاء متطلبات البيانات صغيرة عبر تضمين الفيزياء المعروفة في عملية التعلم. يستخرج أحد الأساليب معلمات مرتبطة بالتقادم من منحنى شحن واحد للبطارية باستخدام نموذج قائم على الفيزياء قابل للتعميم، ثم يزوّد تلك المعلمات لشبكة عصبية عميقة [3]. أسلوب آخر يدمج المعادلة التفاضلية الجزئية (PDE) لقانون فيك (Fick's law) للانتشار من نموذج الجسيم الواحد (single-particle model) في تدريب الشبكة العصبية لتقدير حالة الشحن وحالة الصحة للبطارية [9]. أسلوب ثالث يجمع بين فرع شبكة عصبية قائم على معلومات واجهة الإلكتروليت الصلبة (SEI) مبني من طبقات إسقاط خطية مع فيزياء مضمنة، وفرع شبكة عصبية تلافيفية موسعة (dilated convolutional neural network) خاص بالمهمة وقائم على البيانات [4]. في كل حالة، تُقيّد الفيزياء الجزء القائم على البيانات أو تزوده ببنية بحيث يحتاج إلى بيانات أقل أو درجات حرية أقل.

النتائج المقاسة لافتة لكن كل منها يأتي من مجموعة بياناتها الخاصة ومجموعة خطوط أساس خاصة بها. باستخدام بيانات من دورة واحدة عبر ثلاثة أنواع من البطاريات وسبعة ظروف تشغيلية، حققت الطريقة القائمة على الفيزياء متوسط RMSE قدره 11.42 دورة ومتوسط MARE قدره 3.19% [3]. طريقة منحنى الشحن الواحد القائمة على الفيزياء خفّضت RMSE بأكثر من 45% وMARE بنسبة 44% مقارنة بطريقتين من أحدث طرق التعلم القائم على البيانات [3]. على مجموعة بيانات Stanford-MIT-Toyota-battery، صُمم SEI-DCN للتنبؤ بـ RUL باستخدام أربع نقاط فقط من دورة الحياة، وأُفيد بأنه حقق دقة تنبؤ عالية جداً [4]. مع بيانات تدريب محدودة، قدّر PINN الخاص بقانون فيك حالة الشحن بـ RMSE يتراوح بين 0.014% و0.2% وحالة الصحة بـ RMSE يتراوح بين 1.1% و2.3% [9]. هذه النتائج الثلاث تأتي من ثلاث مجموعات بيانات مختلفة، وثلاثة مقاييس مختلفة، وخطوط أساس مقارنة مختلفة، لذا لا يمكن ترتيبها مقابل بعضها البعض مباشرة.

عائلة ثانية تعامل بيانات الدورات كتسلسل أو صورة وتطبق بنى عميقة شائعة في مجالات السلاسل الزمنية الأخرى. تستخدم بنية CNN-LSTM مع انتباه متعدد الرؤوس (multi-head attention) شبكات CNN لاستخراج الميزات المحلية، وشبكات LSTM لنمذجة الاتجاهات طويلة الأمد، والانتباه لإعادة معايرة أهمية الميزات عبر الخطوات الزمنية [2]. أسلوب متصل ولكن مختلف، وهو CNN-LSTM-DRS، يمثل المدخلات كصور رمادية موحدة الحجم ويستخدم اختيار الانحدار الديناميكي (dynamic regression selection) لاختيار النماذج الفرعية وفقاً لأدائها التنبؤي المحلي [1]. كلا الأسلوبين يجمعان بين مكونات تلافيفية وتكرارية (convolutional and recurrent)، لكن الأول يضيف انتباهاً عبر الخطوات الزمنية بينما الثاني يضيف تمثيلاً بالصور بالإضافة إلى آلية اختيار النماذج الفرعية.
تقييماتهما هي مقارنات داخلية كل منها مقابل مكوناتها الأبسط. على تسلسلات نافذة منزلقة معيارية (normalized sliding-window sequences) من مجموعة بيانات بطارية NASA، حسّن الهجين CNN-LSTM-attention دقة التنبؤ ومتانته مقارنة بمكوناته الفردية من CNN وLSTM في تجارب Leave-One-Battery-Out وTemporal Split [2]. على مجموعة بيانات بطارية NASA، تفوق CNN-LSTM-DRS على نماذج CNN وLSTM المستقلة عبر أحجام بيانات 60% و70% و80% [1]. كلاهما يستخدم مجموعة بيانات بطارية NASA، لذا يبدوان قابلين للمقارنة ظاهرياً، لكن المقارنات المُبلّغ عنها هي كل منها مقابل خطوط أساس CNN وLSTM الخاصة بتلك الورقة، وليس مقابل بعضهما البعض، وبروتوكولات التجارب تختلف (Leave-One-Battery-Out وTemporal Split للهجين ذي الانتباه، مقابل نسب حجم بيانات متفاوتة لـ DRS). لا يوجد ادعاء يقارن CNN-LSTM-attention مباشرة مع CNN-LSTM-DRS.
أسلوب ثالث للتسلسل العميق يستعير نموذجاً أساسياً كبيراً مُدرَّباً مسبقاً للسلاسل الزمنية. يعزز أسلوب Lag-Llama RUL عملية الترميز (tokenization) بتحليل الترابط الذاتي (autocorrelation analysis)، ويُدرَّب مسبقاً على مجموعة بيانات RWTH Aachen University، ويُضبط دقيقاً على مجموعات بيانات مستهدفة محددة هي CALCE وNASA وMIT وBAWAII [5]. هذا مختلف بنيوياً عن هجائن CNN-LSTM: فهو يعتمد على التدريب المسبق على مجموعة بيانات واحدة يليه الضبط الدقيق على عدة مجموعات أخرى، بدلاً من تدريب بنية مخصصة من الصفر على مجموعة بيانات واحدة.

بالنسبة لمن يبني نظاماً، هذا يعني أمرين. أولاً، إذا كان الهدف هو نشر مقارنة، فالتصرف الصادق هو إعادة تنفيذ عدة طرق على مجموعة بيانات مشتركة واحدة (يفضل أن تكون BatteryLife، نظراً لحجمها وتنوعها) بدلاً من اقتباس الرقم المُبلّغ ذاتياً من كل ورقة كما لو كانت على قدم المساواة. ثانياً، إذا كان الهدف هو شحن أداة تنبؤ عاملة بسرعة، فينبغي أن يُحدَّد اختيار الطريقة بناءً على البيانات المتاحة فعلياً (منحنى شحن واحد، أو حفنة من الدورات المبكرة، أو منحنيات كاملة من الدورة إلى الفشل، أو أطياف معاوقة) وليس بناءً على أي ورقة تُبلّغ عن أقل رقم، لأن الأرقام ليست على أرضية متساوية.
الحدود والأسئلة المفتوحة
الحد الأساسي مذكور من المصادر نفسها: المعايير غير المتسقة والمحدودة تجعل فعالية خطوط الأساس غير واضحة وتترك من غير المؤكد ما إذا كانت النماذج الشائعة في مجالات السلاسل الزمنية الأخرى فعّالة في التنبؤ بعمر البطارية [11]. لا يوجد ادعاء في هذه المجموعة يُبلّغ عن تشغيل مباشر للطرق القائمة على الفيزياء وطرق الانحدار التعلمي الآلي وطرق التسلسل العميق على مجموعة بيانات مشتركة واحدة ببروتوكول مشترك واحد، لذا لا يمكن الإجابة على سؤال البحث كما طُرح (أي أسلوب هو الأكثر دقة والأفضل معايرة بشكل عام) مباشرة من الأدلة؛ يمكن الإجابة عليه فقط طريقة تلو الأخرى، ومجموعة بيانات تلو الأخرى.
حد ثانٍ يتعلق بالمعايرة تحديداً. فقط طرق العملية الغاوسية [13][7] والبيان العام حول فترات الثقة الأوسع للطرق القائمة على البيانات [14] تتحدث عن المعايرة على الإطلاق. لا يُبلّغ أي من أوراق التسلسل العميق [1][2][5] أو أوراق النماذج القائمة على الفيزياء [3][4][9] عن مقاييس المعايرة (مثل تغطية فترات التنبؤ) في الادعاءات المُعطاة هنا، رغم أن العديد منها يُبلّغ عن مقاييس دقة النقطة مثل RMSE أو MARE أو تخفيض MAE. أي مسار عمل يحتاج فترات RUL معايَرة، على سبيل المثال لجدولة الصيانة، لديه حالياً أقوى دعم من أدبيات GP، وليس من أوراق التسلسل العميق أو القائمة على الفيزياء المذكورة.
ثالثاً، الطرق القائمة على الفيزياء التي تحتاج بيانات قليلة جداً (دورة واحدة [3]، أربع نقاط من دورة الحياة [4]) تُقيَّم على عائلات بيانات محددة (ثلاثة أنواع من البطاريات وسبعة ظروف تشغيلية [3]؛ مجموعة بيانات Stanford-MIT-Toyota-battery [4]) وليس من الثابت من هذه الادعاءات ما إذا كانت دقة البيانات المنخفضة هذه تصمد على الظروف الأكثر تنوعاً الممثلة في BatteryLife (8 أشكال، 59 نظاماً كيميائياً، 9 درجات حرارة تشغيلية، 421 بروتوكولاً [11]). استقراء تلك النتائج ذات البيانات المنخفضة إلى أسطول ذي كيميائيات أو أشكال مختلفة سيكون استدلالاً يتجاوز ما تدعمه الادعاءات.
وأخيراً، المفاضلة بين الطرق القائمة على النموذج والطرق القائمة على البيانات مذكورة فقط بشكل مشروط: يمكن للطرق القائمة على النموذج أن تؤدي بشكل أفضل فقط عندما يُنمذج تدهور النظام بدقة [14]، والنمذجة الدقيقة تتطلب معرفة مسبقة واسعة وقد تنطوي على حسابات مكلفة [14]. ما إذا كان يمكن تلبية هذا الشرط بتكلفة زهيدة كافية لتركيبة وشكل بطارية معينين هو حكم هندسي، وليس أمراً تحسمه الادعاءات هنا، وينبغي التحقق منه حالة بحالة بدلاً من افتراضه.
كيف يُبنى
كيف تبنيه، أو كيف تستخدمه
- اختر نظام البيانات أولاً. قرر ما إذا كان النشر يمتلك تاريخاً كاملاً من الدورة إلى الفشل (مما يفضل نماذج التسلسل العميق مثل CNN-LSTM مع الانتباه [2] أو CNN-LSTM-DRS [1])، أو فقط حفنة من الدورات المبكرة أو منحنى شحن واحد (مما يفضل طريقة الاستخراج القائمة على الفيزياء [3] أو SEI-DCN [4])، أو أطياف معاوقة (مما يفضل طريقة GP-EIS [7])، أو حاجة إلى تنبؤات طويلة المدى معايَرة من منحنيات السعة-الدورة (مما يفضل انحدار GP [13]). ينبغي اتخاذ هذا الاختيار قبل أي نمذجة، إذ لم يُظهر أي من الطرق هنا أنه قابل للتبديل عبر أنظمة البيانات.

- نفّذ البنية المختارة.

- بالنسبة لأسلوب PINN، ضمّن المعادلة الحاكمة مباشرة في دالة الخسارة. دمج المعادلة التفاضلية الجزئية لقانون فيك للانتشار من نموذج الجسيم الواحد في هدف تدريب الشبكة العصبية لتقدير حالة الشحن وحالة الصحة معاً [9]. تحقق من عدم إعطاء الشبكة معلمات أكثر مما تتطلبه موازنة الفيزياء، إذ إن النماذج القائمة على الفيزياء تحتاج أصلاً إلى العديد من المعلمات، وإضافة المزيد يفسد الغرض من تقليل الحاجة للبيانات [9].
- إذا كنت تُدرِّب نموذجاً أساسياً مسبقاً، اتبع الوصفة ذات المرحلتين. درّب مسبقاً على مجموعة بيانات RWTH Aachen University، عزّز الترميز بتحليل الترابط الذاتي، ثم اضبط بدقة بشكل منفصل على كل مجموعة بيانات مستهدفة (CALCE وNASA وMIT وBAWAII) [5]. قيّم تخفيض MAE بشكل منفصل لكل مجموعة بيانات ضبط دقيق، إذ أظهرت مجموعات البيانات الأربع درجات مختلفة من التحسن (43.2% إلى 91.1%) [5].
- قيّم باستخدام نفس بروتوكول التقسيم المستخدم من قِبل أقرب طريقة مذكورة. بالنسبة لنماذج التسلسل العميق القائمة على NASA، أعد إنتاج تجارب Leave-One-Battery-Out وTemporal Split [2] أو غيّر حجم البيانات عبر 60% و70% و80% [1]، حسب الطريقة المذكورة التي توسعها. لا تقارن رقمك برقم ورقة أخرى إلا إذا أعدت تشغيل كليهما على نفس التقسيم.
- أضف فحص معايرة. إذا كنت تستخدم GP، تحقق من أن دالة المتوسط تُشفّر بشكل صحيح أي صيغة معروفة لنموذج التدهور [13] وتحقق مما إذا كانت صيغة GP متعددة المخرجات تُحسِّن التنبؤات باستغلال الترابطات عبر الخلايا [13]. إذا كنت تستخدم شبكة عصبية، تذكّر أنها لا توفر حدود ثقة تحليلية [14]، لذا أبلغ فقط عن مقاييس دقة النقطة بصدق بدلاً من الادعاء بفترات معايَرة لا يمكنها إنتاجها.
- أبلغ عن نقاط الفشل بشكل صريح. لاحظ ما إذا كانت أنماط التدهور تتحول (فقدان المواد الفعالة في أي من القطبين، أو فقدان مخزون الليثيوم [12]) بطرق لم تغطها بيانات التدريب، ولاحظ ما إذا كان النشر يتطابق مع ظروف التشغيل (درجة الحرارة، البروتوكول) التي تغطيها مجموعة البيانات المختارة، إذ أُشير إلى الظروف المخبرية الضيقة كخطر على قابلية التعميم [11].

يبني السكربت أدناه مسار عمل صغيراً وقابلاً لإعادة الإنتاج لـ RUL على مخطط SQLite الخاص بالمشروع نفسه. يقرأ الأشرطة اليومية (bars) من جدول bars (tf='1d')، ويعامل close كبديل لنسبة سعة البطارية من القيمة الأولية (إشارة بديلة نظراً لعدم وجود حقول خاصة بالبطارية في المخطط)، ويُعرِّف نهاية العمر بالنقطة التي تنخفض فيها هذه الإشارة المعيارية إلى 80% من قيمتها الأولية، اتباعاً لتعريف نهاية العمر عند 80% من السعة الأولية [11]. ثم ينفذ ثلاثة خطوط أساس أمينة للآليات المذكورة على نطاق قابل لإعادة الإنتاج وخفيف من حيث استهلاك المعالج: (1) منحدر عملية غاوسية بنواتي RBF والضجيج الأبيض (white-noise) ومتوسط صفري افتراضي من sklearn، خط أساس GP قياسي يمكن توسيعه بدالة متوسط تدهور صريحة عندما تكون الصيغة الوظيفية معروفة [13]؛ (2) منحدر تسلسل صغير بأسلوب CNN-LSTM (منفَّذ بلبنات بناء numpy/sklearn العادية كبديل لمراحل ميزات CNN وLSTM) كخط أساس قائم على البيانات، متبعاً بنية CNN-ثم-LSTM [2][1]؛ و(3) ميزة إنتروبيا عينة بسيطة زائد انحدار Bayesian ridge خطي، متبعاً فكرة إنتروبيا العينة زائد النمذجة التنبؤية البايزية [8]. يقيّم السكربت RMSE للـ RUL المتنبأ به (بخطوات زمنية) لكل طريقة على جزء محجوز من سلسلة كل رمز، ويحسب تغطية فترة التنبؤ 95% لـ GP، ويطبع جدول مقارنة. ولأن التشغيل يستخدم أسعار الإغلاق اليومية لـ AAPL/MSFT/BTC-USD التي لا تعبر أبداً عتبة 80%، فإن find_eol_index تُعيد طول السلسلة، وقيم RMSE (~286 خطوة) لا تحمل أي معلومة عن دقة RUL؛ الجدول يُظهر أن مسار العمل يُنفَّذ من البداية إلى النهاية لكنه لا يشكل مقارنة طرق. تغطية GP المقاسة تبلغ حوالي 0.16، أقل بكثير من الهدف الاسمي 0.95، مما يُظهر أن نواة خط الأساس ومعلماتها تحتاج إلى ضبط قبل أن يخدم هذا الإطار كمعيار معايرة. كل شيء حتمي ويعمل دون وصول للشبكة في أقل بكثير من ثلاث دقائق على المعالج لأحجام نموذجية لجدول bars.

سيُظهر المشروع بأمانة شيئاً واحداً بالضبط: هل تحافظ إعادة تنفيذ خفيفة تعمل فقط على المعالج للفكرة الأساسية لكل آلية (GP بمتوسط صريح، منحدر تسلسل محلي+اتجاه، إنتروبيا+Bayesian ridge) على الترتيب الذي تُبلّغ عنه كل ورقة أصلية مقابل خطوط أساسها الخاصة، على مجموعة بيانات مشتركة واحدة ووسم RUL مشترك واحد (80% من السعة الأولية [11]). سنحكم على النجاح بناءً على ما إذا كانت فترات التنبؤ لـ GP لدينا تغطي فعلياً RUL المحجوز بالمعدل الاسمي بعد ضبط النواة والمعلمات، إذ يُظهر تشغيل العرض التوضيحي الحالي تغطية 0.16 مقابل هدف اسمي 0.95، مما يشير إلى أن الإطار يحتاج تلك الإصلاحات ليكون ذا معنى، وبناءً أيضاً على RMSE مقارنة بخط أساس بسيط للاستمرارية (توقع انحدار RUL الأخير المُلاحظ إلى الأمام).
